I&#8217;ll be sharing more posts about my journey with this framework soon.</p><p>However, one limitation to talk about is, The framework&#8217;s native chat clients are mainly designed for &#120276;&#120327;&#120322;&#120319;&#120306; and &#120290;&#120317;&#120306;&#120315;&#120276;&#120284; models. That means, if you want to use &#120316;&#120321;&#120309;&#120306;&#120319; &#120287;&#120287;&#120288;&#120320; like &#120282;&#120306;&#120314;&#120310;&#120315;&#120310;, there&#8217;s no direct way to integrate them.</p><p>That means if you wanted to integrate <strong>Gemini</strong>, <strong>Claude</strong>, or other models through frameworks like <strong>LiteLLM</strong>, there was no out-of-the-box way to do it.</p><div><hr></div><h3><strong>So, I Built It Myself &#127919;</strong></h3><p>After exploring the ecosystem, I realized no one had yet built a <strong>Gemini integration</strong> for Microsoft&#8217;s Agent Framework.<br>So, I decided to create one from scratch.</p><p>This integration allows developers to <strong>seamlessly plug Gemini models</strong> into the Agent Framework, just like any native Azure or OpenAI client.</p><div><hr></div><h3><strong>Getting Started</strong></h3><p>First, install the Google GenAI package:</p><pre><code><code>pip install google-genai

Let's break it down.</p><h2>The Broken Promise of Infinite Context</h2><p>In the early days of Large Language Models (LLMs), our focus was squarely on <strong>prompt engineering</strong>. The community developed intricate methods for structuring queries, including examples, context, and specific instructions all within the prompt itself. Major AI labs all released extensive guides on this craft.</p><p>Then came the era of massive context windows. With Google announcing a 1 million token window and models like "Llama 4 Scout" handling 10 million, a popular narrative emerged: <strong>"RAG (Retrieval-Augmented Generation) is dead."</strong> The thinking was that we could simply feed entire databases or codebases into the context and let the model figure it out.</p><p>Similarly, with the advent of the <strong>Model Context Protocol (MCP)</strong>&#8212;an open standard for connecting LLMs to tools and external data&#8212;the hype suggested that complex retrieval systems were no longer necessary. We could just plug hundreds of servers into our agents.</p><p>However, reality proved to be more complicated. As models became more powerful, a new set of problems emerged, revealing that a longer context window isn't a silver bullet. In fact, benchmarks began to show that longer context doesn't always lead to better responses&#8212;and can sometimes cause catastrophic failures.</p><h2>The Four Horsemen of Context Failure</h2><p>Why do models misbehave long before their context windows are full? The issue lies in how models handle the information they're given. Four primary problems have surfaced:</p><h4>1. Context Poisoning</h4><p>This occurs when a hallucination or an error creeps into the context. The agent then accepts this false information as truth. Undoing this damage is incredibly difficult because the agent doesn't know what it doesn't know, leading it down a path of compounding mistakes.</p><h4>2. Context Distraction</h4><p>As the context grows, the model can become overly focused on the information within the window, neglecting its vast internal knowledge learned during training. Think of a very long ChatGPT session where its responses become strange and detached from facts. If a powerful model like Llama 3.1 405B sees its correctness fall after just 32,000 tokens, what's the point of a million-token window?</p><h4>3. Context Confusion</h4><p>Superfluous or poorly organized content in the context window can degrade the quality of the model's reasoning and response. This is a major limitation for agents using many tools. While models can typically handle fewer than 30 tools effectively, performance fails miserably as you scale up to 100 or more. The agent simply gets confused by the sheer volume of options.</p><h4>4. Context Clash</h4><p>This is a more severe stage of context confusion where new information or tool instructions directly conflict with existing information in the context. For example, research has shown that "sharded instructions" (instructions broken up and spread throughout the context) can cause performance to plummet. This happens because agents dynamically assemble context from documents, tool calls, and sub-agents. If the instructions from one tool clash with the overall prompt or another tool's output, the agent's reasoning breaks down.</p><h2>A Framework for Effective Context Engineering</h2><p>These challenges highlight the need to move beyond simple prompting and embrace a more sophisticated approach. As Karpathy put it, context engineering is the "delicate art and science of filling the context window with <em>just the right information</em> for the next step."</p><p>Based on current research and industry best practices, we can distill this "art and science" into a practical four-step framework: <strong>Offload, Retrieve, Extract, and Isolate.</strong></p><div><hr></div><h3>1. Offload Context</h3><p>The first principle is to not put everything into the model's context window in the first place. Store information externally and only bring it in when needed.</p><ul><li><p><strong>Methods:</strong> This can be done through long-term memory stores, a simple "scratchpad," or a more formal "agent state" manager.</p></li><li><p><strong>Favorite Tactic:</strong> Scratchpads are incredibly effective. Just as humans jot down notes to organize their thoughts, an agent can use a scratchpad to track the output of previous tool calls, manage complex sequential tasks, and ensure that costly mistakes are not repeated.</p></li></ul><h3>2. Retrieve Context</h3><p>Once context is offloaded, you need an intelligent way to pull back only the most relevant pieces of information for the task at hand.</p><ul><li><p><strong>Retrieve Relevant Tools:</strong> For agents with more than 30 tools, simply listing them all is inefficient. A new approach involves using RAG <em>on the tool descriptions themselves</em>. This "Tool Loadout" technique, detailed in a recent paper (<a href="https://arxiv.org/abs/2405.03275">arXiv:2405.03275</a>), helps the agent find the right tool for the job from a vast library.</p></li><li><p><strong>Retrieve from Memory:</strong> This involves pulling from different memory types:</p><ul><li><p><strong>Procedural:</strong> "How-to" instructions.</p></li><li><p><strong>Semantic:</strong> Factual knowledge.</p></li><li><p><strong>Episodic:</strong> Past experiences, crucial for multi-turn conversations.</p></li></ul></li><li><p><strong>Agentic RAG:</strong> A more advanced form of RAG where the agent actively decides what knowledge to retrieve.</p></li></ul><h3>3. Extract Context</h3><p>Just because you've retrieved information doesn't mean it should all be passed to the model. The next step is to compress and refine it by extracting only the relevant parts.</p><ul><li><p><strong>Summarize &amp; Trim:</strong> This involves summarizing conversations (CoT to CoD, or "Chain of Thought" to "Chain of Draft") or pruning irrelevant details from retrieved documents. This was initially a trick for small context windows, but it's essential even with large ones to prevent Context Distraction.</p></li><li><p><strong>Advanced Context Pruning:</strong> Instead of just summarizing, modern techniques use dedicated models to intelligently prune context. A groundbreaking paper introduced <strong>Provence</strong> (<a href="https://arxiv.org/abs/2401.16214">arXiv:2401.16214</a>), an efficient and robust context pruner. It works by:</p><ul><li><p>Treating pruning as a sequence labeling task, allowing it to understand relationships between sentences.</p></li><li><p>Dynamically detecting how much pruning is needed, rather than using a fixed length.</p></li><li><p>Unifying pruning with re-ranking, making it a nearly zero-cost step in a standard RAG pipeline. Isolate Context</h3><p>To prevent Context Clash and Confusion, you must create boundaries. Isolate different pieces of context so they don't interfere with each other.</p><ul><li><p><strong>Methods:</strong> This can be achieved by partitioning context within the agent's state, sandboxing processes, or, most effectively, using a multi-agent architecture. This is sometimes called "Context Quarantine."</p></li><li><p><strong>Multi-Agent Systems:</strong> By assigning different tasks to different agents (e.g., a Claude Sonnet model for retrieval and a Claude Opus model for reasoning), you can achieve significant performance gains. This ensures that the context for one task doesn't bleed into and corrupt another.</p></li><li><p><strong>The Challenge:</strong> The primary difficulty with this approach is managing context sharing <em>between</em> the agents, which is an active area of research.</p></li></ul><h2>The Future is Context-Aware</h2><p>As we build increasingly complex and autonomous AI agents, our success will not be measured by the size of our models or their context windows. It will be determined by our ability to master the flow of information.</p><p>Context engineering is the discipline that will enable us to build robust, reliable, and truly intelligent systems. It's about being a curator, a librarian, and an architect of information, ensuring that our agents have exactly what they need to think clearly and act decisively.
